CNN and RNN using Deepfake detection

The rise of deep fake technology has ignited widespread societal apprehensions about potential security risks and the dissemination of false information. Despite extensive research into deepfake detection, effectively discerning low-quality deepfakes and simultaneously identifying variations in their quality remains a significant and formidable challenge. This investigation explores the dynamic field of deep fake detection, focusing specifically on video analysis targeting facial manipulations. The study introduces Celeb-DF, a substantial dataset comprising high- quality deep fake videos of celebrities, challenging prevailing detection methods. Additionally, a revolutionary Quality-Agnostic Deep Fake Detection (QAD) framework addresses the intricate task of simultaneously recognizing diverse qualities of deep fakes, surpassing established benchmarks across multiple datasets. The paper highlights ongoing efforts to enhance deep fake detection strategies, incorporating advanced models such as Stable Diffusion, and employing interpretability-through-prototypesn by merging fine-tuned Vision Transformers with Support Vector Machines. Due to the abuse of deep forgery technology, the research on forgery detection methods has become increasingly urgent. The corresponding relationship between the frequency spectrum information and the spatial clues, which is often neglected by current methods, could be conducive to a more accurate and generalized forgery detection. Motivated by this inspiration, we propose a wavelet‐based texture mining and enhancement framework for face forgery detection. First, we introduce a frequency‐guided texture enhancement (FGTE) module that mining the high‐frequency information to improve the network’s extraction of effective texture features. Next, we propose a global–local feature refinement (GLFR) module to enhance the model’s leverage of both global semantic features and local texture features. Moreover, the interactive fusion module (IFM) is designed to fully incorporate the enhanced texture clues with spatial features. The proposed method has been extensively evaluated on five public datasets, such as FaceForensics++ (FF++), deepfake (DF) detection (DFD) challenge (DFDC), Celeb‐DFv2, DFDC preview (DFDC‐P), and DFD, for face forgery detection, yielding promising performance within and cross dataset experiments.

Deep Fakes: A Looming Challenge for Privacy, Democracy, and National Security

Deep fakes, synthetic media generated through artificial intelligence (AI) techniques, have become a growing concern due to their potential for misinformation, manipulation, and security threats. As the sophistication of deep fake technology continues to evolve, traditional methods of detection are becoming less effective, thus prompting the need for advanced AI-driven solutions. This article explores the various AI techniques employed in deep fake detection, such as deep learning, neural networks, and computer vision algorithms. A review of the latest advancements in AI technologies, including Convolutional Neural Networks (CNNs), Recurrent Neural Networks (RNNs), and Generative Adversarial Networks (GANs), is presented to highlight their roles in identifying deep fakes. Additionally, we explore challenges related to data availability, model robustness, and ethical implications. The paper concludes by proposing a hybrid detection framework that integrates multiple AI techniques to enhance the accuracy and efficiency of deep fake identification.

Deepfakes, which are synthetic media realistic in nature generated using artificial intelligence (AI); pose a significant threat to individuals and society. The rapid advancement of deepfake technology has led to the creation of highly realistic synthetic content covering images, videos, audio, and news. While deepfake applications offer creative possibilities, their misuse for misinformation, identity fraud, and cybersecurity threats necessitates robust detection methods. Deepfake crimes are rising daily, wherein deepfake media detection has become a big challenge and has high claim in digital forensics. This review explores the state-of-the-art deep learning (DL) techniques for deepfake detection of four parameters, namely images, videos, audio, and news. The ML approaches rely on handcrafted features but struggle with evolving deepfake methods. In contrast, DL techniques, such as Convolutional Neural Networks (CNNs) and Long Short-Term Memory (LSTM) networks, have demonstrated superior detection accuracy by learning discriminative features. Even Recurrent Neural Networks (RNNs), and Transformer-based architectures like Bidirectional encoder representations from transformers (BERT), have demonstrated superior accuracy in identifying manipulated content. Furthermore, recent advancements such as Vision Transformers (ViTs) and Explainable AI (XAI) models are enhancing detection interpretability and robustness. This review highlights the future research directions for strengthening deepfake detection mechanisms. The rapid advancements in deepfake generation necessitate continuous research and development of countermeasures.

Deepfake techniques can forge the visual or audio signals in the video, which leads to inconsistencies between visual and audio (VA) signals. Therefore, multimodal detection methods expose deepfake videos by extracting VA inconsistencies. Recently, deepfake technology has started VA collaborative forgery to obtain more realistic deepfake videos, which poses new challenges for extracting VA inconsistencies. Recent multimodal detection methods propose to first extract natural VA correspondences in real videos in a self-supervised manner, and then use the learned real correspondences as targets to guide the extraction of VA inconsistencies in the subsequent deepfake detection stage. However, the inherent VA relations are difficult to extract due to the modality gap, which leads to the limited auxiliary performance of the aforementioned self-supervised methods. In this paper, we propose Predictive Visual-audio Alignment Self-supervision for Multimodal Deepfake Detection (PVASS-MDD), which consists of PVASS auxiliary and MDD stages. In the PVASS auxiliary stage in real videos, we first devise a three-stream network to associate two augmented visual views with corresponding audio clues, leading to explore common VA correspondences based on cross-view learning. Secondly, we introduce a novel cross-modal predictive align module for eliminating VA gaps to provide inherent VA correspondences. In the MDD stage, we propose to the auxiliary loss to utilize the frozen PVASS network to align VA features of real videos, to better assist multimodal deepfake detector for capturing subtle VA inconsistencies. We conduct extensive experiments on existing widely used and latest multimodal deepfake datasets. Our method obtains a significant performance improvement compared to state-of-the-art methods.

The increasing computational power will significantly enhance the capabilities of deep learning algorithms, making the creation of indistinguishable human-synthesized videos, commonly known as "deep fakes," quite straightforward. These deep fakes, featuring realistic face swaps, will be susceptible to misuse in scenarios involving political manipulation, fabricated terrorism incidents, revenge pornography, and extortion. In this future work, we will present an innovative deep learning-based approach for effectively identifying AIgenerated fake videos in contrast to genuine ones. Our approach will excel at automatically detecting deep fakes involving face replacement and reenactment, thereby utilizing Artificial Intelligence (AI) to combat the misuse of AI technology. Our system will employ a Res-Next Convolutional Neural Network to extract framelevel features. These extracted features will be subsequently utilized to train a Long Short-Term Memory (LSTM)-based Recurrent Neural Network (RNN) for the classification of videos, determining whether they have undergone manipulation (i.e., whether they are deep fakes) or if they are authentic videos. To ensure that our model performs optimally in real-time scenarios, we will evaluate our method using a substantial dataset that combines various available datasets, such as Face-Forensic++, the Deepfake Detection Challenge, and Celeb-DF. We will also demonstrate how our system will achieve competitive results using a straightforward and robust approach.

This comprehensive study investigates the pervasive issue of deep fakes within the context of deep learning applications, focusing on their detection and production. Utilizing a diverse array of deep learning algorithms, including InceptionResnetV2, VGG19, CNN, Xception, InceptionV3, EfficientNetB1, DenseNet121, Hybrid Model, LSTM, ResNext-LSTM, and MRI-GAN, the research systematically evaluates their effectiveness in detecting deep fakes. Results reveal varying levels of accuracy, with Xception emerging as the most precise algorithm, achieving an accuracy of 99.32%. Notably, InceptionResnetV2 and DenseNet121 also demonstrate robust performance, with accuracies surpassing 99%. However, certain models like VGG19 and LSTM exhibit lower accuracy rates, underscoring the need for further refinement. These findings underscore the urgent necessity for robust detection mechanisms amidst the proliferation of malicious deep fakes, safeguarding against potential societal ramifications such as misinformation and privacy breaches.

Are Deep Fakes a Shallow Concern? A Critical Analysis of the Likely Societal Reaction to Deep Fakes

Following the recent initiatives for the democratization of AI, deep fake generators have become increasingly popular and accessible, causing dystopian scenarios towards social erosion of trust. A particular domain, such as biological signals, attracted attention towards detection methods that are capable of exploiting authenticity signatures in real videos that are not yet faked by generative approaches. In this paper, we first propose several prominent eye and gaze features that deep fakes exhibit differently. Second, we compile those features into signatures and analyze and compare those of real and fake videos, formulating geometric, visual, metric, temporal, and spectral variations. Third, we generalize this formulation to the deep fake detection problem by a deep neural network, to classify any video in the wild as fake or real. We evaluate our approach on several deep fake datasets, achieving 92.48% accuracy on FaceForensics++, 80.0% on Deep Fakes (in the wild), 88.35% on CelebDF, and 99.27% on DeeperForensics datasets. Our approach outperforms most deep and biological fake detectors with complex network architectures without the proposed gaze signatures. We conduct ablation studies involving different features, architectures, sequence durations, and post-processing artifacts.

Abstract—Deepfake technology, driven by generative adversarial networks (GANs), poses significant challenges in digital security, misinformation, and privacy. Detecting deepfakes in images and videos requires advanced deep learning models. This study explores deepfake detection using convolutional neural networks (CNNs), recurrent neural networks (RNNs), and transformer-based architectures like Vision Transformers (ViTs). We employ Meso4_DF deepfake detection pipeline that uses TensorFlow/Keras, PyTorch, OpenCV for processing, with Dlib, Scikit-Image, and NumPy for feature extraction, leveraging transfer learning for enhanced accuracy. Video analysis includes frame extraction and temporal feature learning using LSTMs and 3D CNNs. Experimental results demonstrate that deep learning-based methods achieve high accuracy in distinguishing real and manipulated media, offering a robust approach to deepfake detection. Deep learning has been widely used in fields such as natural language processing, computer vision, and driverless vehicles, leading a new wave of artificial intelligence. Deep learning advances however have also been used to create technologies that pose potential threats to national security, social stability, and personal privacy. For example, deepfakes that have recently attracted widespread attention worldwide, which could generate seemingly realistic fake images, audio and video content. This article introduces the background of deepfakes and the principles of deepfakes creation, and then outlines and analyzes the detection methods and datasets for different types of deepfakes, including images, videos, audios, etc. Finally, the article discusses potential research directions and challenges of deepfakes detection and prevention.

Deepfake technology, which allows the creation of manipulated, yet highly realistic, content have made it difficult to ascertain the integrity of any form of digital media. In order to solve this problem, we introduce an end-to-end deep-learned framework called Discrepancy-Aware Forgery Detection Network (DAFDN) dedicated to the task of detecting forged media to tackle representation biases and capture irregular patterns in forgery samples. This consists of a Feature Representation Extractor (FRE) and a Feature Refinement Module (FRM), and both jointly generates representative but not biased feature representations. In addition, an Attention-Guided Feature Rectification (AGFR) mechanism is adopted to both combine and refine features, and the Discrepancy-Aware Interaction Module (DAIM) explores the manipulation clues through regional and channel-level discrepancy. To improve detection, the framework uses Region-Aware Forgery Detection (RAFD) by spatial analysis and Channel Discrepancy Analysis (CDA) by channel-wise exploration. Utilizing data, no later than October 2023, our method surpasses state-of-the-art methods under challenging datasets such as Celeb-DF, WildDeepfake, and DFDC, indicating our success in detecting minute manipulations. This research significantly enhances deepfake detection by utilizing sophisticated techniques to fine-tune representations and exploit differences.

Deepfake technology being constantly developed at a fast pace, poses a great danger to the authenticity of media content, and thus prompt detection frameworks are required. This paper reviews the state of the art in deepfake detection systems focusing on four shallow deep learning CNN models, XceptionNet, EfficientNetV2M, EfficientNetV2S, InceptionResNetV2. This paper focuses on the datasets and model architectures. The selected metrics are explained which concretize the relevance and versatility of these approaches. The research applies a deep learning method that is resource efficient and cost effective, to resolve important problems such as imbalance in data. The tested cases prove the effectiveness of the models in deepfake detection in regard to several cases. The XceptionNet model recorded 98% accuracy in the classification task using the CelebDF-V2 dataset, while the InceptionResNetV2 model achieved 94% accuracy on the FaceForensics++ dataset.

Deepfake technology, which uses artificial intelligence to create realistic fake images, audio, and videos, has raised significant concerns due to its potential for misuse and manipulation. The emergence of deepfake technology poses a significant threat to the integrity of digital content, necessitating robust detection mechanisms. This paper proposes a novel method for deepfake detection by combining Overlapping Multiple Dynamic Images (OMDI) and Inversed Overlapping Multiple Dynamic Images (I‐OMDI). Both representations capture temporal inconsistencies and subtle visual artifacts in fake videos by effectively utilizing spatial–temporal information. Our approach employs EfficientNetB7 as the backbone for feature extraction, enabling the model to distinguish between real and fake videos with high accuracy. By combining OMDI and I‐OMDI with a weighted average strategy, we amplify the strengths of each method. Specifically, we assign equal weights of 0.5 to OMDI and I‐OMDI based on their individual contributions to performance metrics. This balance yields substantial performance improvements across multiple datasets. When evaluated on the Celeb‐DF v2 and DFDC datasets, our proposed model achieves state‐of‐the‐art results, with an AUC score of 0.9952 on Celeb‐DF v2 and 0.9947 on DFDC. These results underscore the robustness of the combined OMDI and I‐OMDI methods in identifying deepfake videos. Furthermore, our model demonstrates superior performance compared to existing methods, including those by Tran et al. and Heo et al., underscoring its effectiveness in practical deepfake detection applications. © 2025 Institute of Electrical Engineers of Japan and Wiley Periodicals LLC.
